Data Acquisition and Preprocessing Techniques for Effective Machine Learning
Abstract
In the world of machine learning, data acquisition and its preprocessing play a vital role for the workflow and affect the model in terms of its performance and reliability. This chapter explores in-depth methods of data acquisition and preparation for the purpose of maintaining data quality and its applicability to machine learning tasks. It begins with an understanding of data-related issues by discussing data acquisition methods, primary and secondary sources of data, forms of data, and data gathering methods such as application programming interfaces, web scraping, and sensor-based methodologies. Then, the attention turns to data cleaning measures such as missing values and variables, outlier detection, and deletion, as well as noise reduction techniques. The chapter also covers some data transformation approaches including normalization and standardization. How categorical data are encoded is also discussed, and then features of the data are covered. A specific subsection on the methods of data augmentation is given outlining the methods that have been used to increase the sizes of datasets such as image-based, text-based, and synthesis-based dataset generation. Data augmentation methods including principal component analysis and t-distributed stochastic neighbor embedding, feature selection methods, and techniques on how to deal with time series data are also discussed. For practical applications, data preprocessing in python is outlined in a case study providing them with a clear perspective between the theory and its application. The readers are also provided with data by discussing the challenges of data acquisition and the solutions available for them. The chapter finishes with the discussion of the latest trends in the field of study, which include training AI to create datasets, using generative AI, training self-supervised networks that require little or no supervision usually delivered by human professionals. In the preceding abstract, it is emphasized that effective techniques for data acquisition and preprocessing are crucial for the construction of good, accurate models of machine learning systems, and therefore for the achievement of reproducible and dependable results in the area.
