Abstract

The quality of input data and the choice of relevant characteristics for analysis determine the quality of prediction models in machine learning and artificial intelligence (AI) systems. Given that of massive databases are more common, feature selection has become a key step toward developing effective AI models. This chapter discusses correlation analysis as an elementary feature selection method and how it can be used to increase the functionality, accuracy, and interpretability of AI systems. Correlation-based feature selection, through the analysis of interactions between variables and their effects on model accuracy, identifies and retains the most relevant features. Thus, shedding off irrelevant or redundant feature individuals, which establish a multicollinearity-correlation analysis lowers the data dimensionality and leads to simpler models. The chapter describes various correlation estimation techniques, including the Pearson, Spearman, and Kendall correlation coefficients. Different methods are used for different data types: continuous, ordinal, or nonlinear. Providing quantitative measures of relationships between features and target variables allows correlation-based methods to signal which features affect model outputs. Correlation score-based feature selection promotes better generalization of AI models to avoid overfitting and improve future predictive performance. In places where many variables are available and only a few contribute meaningfully to decision-making, correlation analysis could be very useful. For example, in health, correlation analysis helps identify the most important patient characteristics relevant for disease outcome, thereby actually reducing the number of features while retaining accuracy in the model. Likewise, in economic modeling, correlation analysis provides identification for key economic indicators that drive the markets and thus make the model work better at predicting stock price or credit risk. Finally, correlation analysis in marketing helps detect consumer behavior patterns that influence purchasing decisions for more focused marketing activities. Therefore, this chapter studies how correlation-based feature selection is incorporated into contemporary machine learning algorithms. For example, although decision trees and random forests do this automatically, applying correlation analysis as a preprocessing step aids interpretability and minimizes noise. Moreover, in deep learning scenarios where input data are often high-dimensional, correlation analysis aids in simplifying the input space, speeding up the training process, and improving model scalability. However, despite its merits, correlation analysis has limitations, chiefly its inability to detect complex and nonlinear correlations between variables. To circumvent this challenge, this chapter recommends the adoption of additional feature selection methods, such as mutual information and wrapper methods, alongside correlation analysis. Overall, this chapter provides a detailed tutorial on the use of correlation analysis in AI feature selection, highlighting its importance for improving model efficiency, accuracy, and interpretability in many applications.
