Abstract

This chapter provides a comprehensive framework for evaluating the robustness of machine learning models under adversarial conditions—a critical capability as artificial intelligence (AI) systems face increasingly targeted threats. It introduces core robustness evaluation strategies, including the use of adversarial inputs, sensitivity metrics, and perturbation stress testing across multiple modalities. Readers will learn how to methodically quantify model resilience using both empirical testing and formal verification, gaining visibility into how models behave under subtle but malicious manipulation. Beyond traditional accuracy metrics, the chapter details how to measure degradation curves, confidence shifts, and adversarial success rates across diverse model architectures. It highlights the importance of architecture-aware evaluation—contrasting vulnerability patterns in convolutional, transformer-based, autoregressive, and multimodal systems—and demonstrates how techniques like adversarial training and certified robustness can be applied to reduce risk. Benchmarking tools such as RobustBench and CleverHans are also explored to support reproducible and defensible robustness evaluations. Security professionals, AI engineers, and risk stakeholders will come away with practical methods for embedding robustness into development and deployment pipelines. This includes understanding how to map architectural attack surfaces, interpret robustness metrics, and document certified boundaries for compliance and governance. Whether used in high-stakes applications or enterprise AI platforms, the tools and strategies in this chapter enable teams to transition from reactive defense to proactive assurance.
