Abstract

This paper introduces a novel approach to the application of robotics and automation withinSmart Agricultural Manufacturing—an overarching industrial paradigm that elevates traditional precision farming into a fully autonomous, deterministically controlled production ecosystem. Rather than treating automated farming as a collection of isolated mechanical tasks, we introduce a scalable, hybrid multi-modal framework focused on robotic systems to optimize the entire production lifecycle, from automated soil preparation to robotic harvesting and post-processing. By integrating Cyber-Physical System (CPS) data streams-including real-time telemetry from autonomous vehicles, robotic actuator data, environmental sensors, and logistics-our system establishes a high-fidelity digital shadow of both the agricultural environment and the automated machinery operating within it. Tailored for large-scale robotic fleets, the framework utilizes hierarchical feature learning to segment critical autonomous operation phases. We propose a dynamic robotic task allocation algorithm, inspired by Dijkstra's shortest path, to engineer optimal ``field-to-factory'' automated workflows, minimizing operational latency and maximizing machine uptime. To handle the high-dimensionality of data from on-board robotic sensors (e.g., LiDAR, hyperspectral cameras), a novel geometric feature selection mechanism eliminates redundancy while preserving latent indicators of crop health and operational efficiency. These refined attributes are projected into a probabilistic state space, allowing individual robotic units or automated zones to exhibit distinct performance signatures. Central to our approach is the construction of an operational similarity graph, which facilitates community detection across the robotic network. These clusters reveal shared optimization strategies, such as superior robotic cultivation protocols and resilient automation configurations. Finally, a ranking-based recommendation engine synergizes local robotic sensor data with global cluster insights to drive prescriptive actions for the autonomous fleet. Validated on an extensive dataset of over 1 million records detailing robotic field operations, our framework achieves a superior average yield forecasting accuracy of 89.2% (a 14% improvement over leading baselines) and a Balanced Error Rate (BER) of 0.5665 for production clustering. These scale-independent metrics prove its efficacy in achieving precision operations and transforming traditional farming into a resilient, high-yield automated manufacturing system.
