Abstract

Wastewater treatment operations generate vast streams of data from sensors, supervisory control systems, and laboratory analyses, yet much of this information remains underutilized. In this chapter, a comprehensive review is presented on how Big Data can be harnessed with machine learning (ML) techniques to predict and enhance wastewater quality. The state of the art in data sources for wastewater systems is summarized, including real-time sensor networks, historical plant records, and emerging Internet of Things (IoT) deployments. Supervised learning methods for regression and classification of water quality indicators are examined alongside unsupervised approaches for pattern discovery and anomaly detection, with a focus on deep learning models for complex, nonlinear behavior. Model development practices are discussed in detail, covering data preparation, training, validation, and performance evaluation metrics common in water quality prediction. These concepts are illustrated through case studies of full-scale wastewater treatment plants (WWTPs) where ML has been applied to forecast key effluent parameters and operational outcomes. Limitations such as data quality issues, model interpretability, and deployment challenges are critically discussed, as are potential biases inherent in data-driven models. Finally, future research directions are explored, highlighting the integration of digital twin frameworks, edge computing, and fully integrated smart wastewater systems. The chapter demonstrates that by combining Big Data with advanced ML, wastewater utilities can move toward predictive operations, proactive management, and improved environmental compliance.
