Harnessing IoT and Machine Learning for Real-Time Intelligence
Abstract
The integration of machine learning (ML) with the Internet of Things (IoT) has revolutionized real-time data processing, automation, and decision-making across diverse industries. This work provides a comprehensive exploration of the advancements, challenges, and future trajectories in IoT–ML convergence, including application areas in edge computing, real-time data acquisition, predictive maintenance (PdM), anomaly detection, and security frameworks. The study discusses architectural considerations for scalable, efficient, and secure deployment of IoT-ML systems, emphasizing performance optimization, latency reduction, and energy efficiency. Some methodologies such as federated learning (FL), transfer learning, and model compression for edge analytics are examined. Furthermore, the work highlights industry applications in smart manufacturing, healthcare, urban infrastructure, precision agriculture, and energy management. Emerging technologies such as fifth-/sixth-generation (5G/6G) networks, quantum computing, and blockchain-based security mechanisms are explored in the context of IoT–ML evolution. The findings underscore the transformative potential of IoT–ML systems in enhancing automation, predictive intelligence, and operational efficiency while addressing critical issues such as interoperability, power consumption, and security. This study serves as a foundational guide for practitioners and researchers, providing insights into the design, implementation, and future directions of real-time IoT-ML systems.
