A Conceptual Causal Neuro-Symbolic Counterfactual Learning Model Based on Intelligent Constraint Solvers: A Literature-Driven Approach
Abstract
The performance of constraint programming solvers in complex combinatorial domains is critically influenced by value-selection heuristics, yet existing learning-based approaches remain largely correlational, offline-trained, and weak in causal interpretability. This article proposes a Causal Neuro-Symbolic Counterfactual Learning (CNSCL) conceptual model for intelligent constraint solvers, derived through a systematic literaturedriven synthesis. The model explicitly formulates value selection as a causal intervention, integrates counterfactual outcome estimation for unchosen values, and embeds solver-internal symbolic feedback within neural learning mechanisms. Unlike existing heuristic learning models, CNSCL enables online, solver-embedded adaptation, supports intervention-invariant generalization, and provides transparent causal explanations for solver decisions. Its competitive edge lies in unifying causal inference, counterfactual reinforcement learning, and neuro-symbolic representation within a single solver-agnostic framework, thereby reducing backtracking, improving robustness under distributional shifts, and enhancing scalability in dynamic optimization environments.
