Soft-TCM: Bridging Causal Depth and Engineering Feasibility via Low-Rank Inertial Manifolds
Abstract
Standard Large Language Models (LLMs) suffer from Rank Collapse in deep layers, behaving as overdamped gradient flows that relax toward a topologically trivial manifold. While Hamiltonian dynamics can theoretically restore signal propagation via symplectic conservation laws, naive implementations face the "Impossible Triangle": doubled memory costs, noise accumulation, and non-differentiable logic. We introduce the Soft-Taiji Computational Matrix (Soft-TCM), a framework that approximates inertial dynamics on a low-rank manifold M๐ โ R๐ . We rigorously derive the Hamiltonian equations from the LogSumExp potential, explicitly addressing the Hopfieldian limit (๐พ โ ๐) to justify the conservative force field. Furthermore, we establish a rigorous isomorphism between Inertial Residual Networks and Linearized State Space Models (SSMs) by performing a complete Taylor expansion of the force field, including the harmonic confinement terms often neglected. Crucially, comparative experiments demonstrate that Soft-TCM (rank ๐ = 8) preserves > 95% of the effective rank of a Full-Rank Hamiltonian system while reducing momentum memory overhead by 99.6%. Sensitivity analysis reveals a "critical mass" at ๐ โ 4, validating the existence of a minimal causal manifold required for metastable dynamics.
