Soft-TCM: Bridging Causal Depth and Engineering Feasibility via Low-Rank Inertial Manifolds
Abstract
Standard Large Language Models (LLMs) suffer from Rank Collapse in deep layers, behaving as overdamped gradient flows that relax toward a topologically trivial manifold. While Hamiltonian dynamics can theoretically restore signal propagation via symplectic conservation laws, naive implementations face the "Impossible Triangle": doubled memory costs, noise accumulation, and non-differentiable logic. We introduce the Soft-Taiji Computational Matrix (Soft-TCM), a framework that approximates inertial dynamics on a low-rank manifold M𝑟 ⊂ R𝑑 . By deriving the Hamiltonian equations from first principles—specifically the LogSumExp potential of Attention—we prove that standard Transformers are merely the overdamped limit of a richer dynamical system. We establish a rigorous isomorphism between Inertial Residual Networks and Linearized State Space Models (SSMs) via Taylor expansion of the force field. Crucially, comparative experiments demonstrate that Soft-TCM (rank 𝑟 = 8) preserves > 95% of the effective rank of a Full-Rank Hamiltonian system while reducing momentum memory overhead by 99.6%. Sensitivity analysis reveals a "critical mass" at 𝑟 ≈ 4, validating the existence of a minimal causal manifold.
