Multi-Dimensional Causal Bias Detection, Cryptographic Verification, and Adversarial Robustness via Distributed Streaming Inference Across AI Recommendation Platforms
Abstract
AI recommendation platforms mediate information discovery for billions of users across e-commerce, hospitality, healthcare, and financial services, yet existing fairness tools operate at the model-training level for single platforms in offline settings—they cannot attribute why bias exists, assess whether bias detectors themselves are robust to adversarial attack, detect coordinated manipulation spanning multiple platforms, or produce cryptographic evidence for regulatory audit. We present a unified architecture for real-time multi-dimensional causal bias detection integrating thirteen technically distinct detection modalities across five processing layers. We introduce a contrastive dual-encoder behavioral-recommendation alignment engine that detects systematic divergence between user behavioral histories and AI recommendation outputs by learning aligned representations via contrastive loss in a shared embedding space. We introduce a distributed incremental causal inference engine that maintains real-time causal directed acyclic graphs through streaming sufficient statistics updates with per-observation complexity and Monte Carlo Shapley attribution. We introduce adversarial robustness analysis comprising perturbation budget certification quantifying the minimum perturbation to change detection decisions, adversarial bias probing, and influence function training data audits tracing bias to specific training examples. We introduce cross-platform coordination detection via temporal exposure graphs with graph neural networks and topological structure detection via persistent homology, exploiting the mathematical property that coordination topology is invariant under continuous deformation. We introduce cross-modal bias fusion with attention-weighted aggregation and uncertainty decomposition into aleatoric and epistemic components, adaptive multi-calibration across computationally identifiable subgroups with concept drift adaptation, and a human-in-the-loop escalation framework with confidence-tier routing. The architecture extends the indicator-based validation system of U.S. Patent No. 11,301,910 B2 with temporal-geospatial verification combining solar physics-based timestamp validation with multi-source consistency triangulation. Cryptographic verification artifacts with Shapley attribution metadata and regulatory attestation chains provide EU AI Act compliance documentation.
