Deep Learning for Climate Anomaly Prediction Using Spatio-Temporal Attention Networks
Abstract
Climate change presents one of the most pressing global challenges of our time, necessitating accurate and timely predictions of climate anomalies.Traditional climate models often struggle with the inherent nonlinearity and high-dimensionality of atmospheric and oceanic data, leading to limitations in capturing complex spatio-temporal dependencies. This paper proposes a novel deep learning framework for climate anomaly prediction, leveraging Spatio-Temporal Attention Networks (STANs).Our approach integrates convolutional neural networks (CNNs) for spatial feature extraction, recurrent neural networks (RNNs) or transformers for temporal sequence modeling, and a sophisticated attention mechanism to dynamically weigh the importance of different spatio-temporal regions. The STAN model is designed to capture intricate long-range dependencies across both geographical space and time, offering enhanced predictive accuracy for extreme weather events, temperature fluctuations, and precipitation anomalies. We demonstrate the efficacy of our framework through extensive experiments on reanalysis climate datasets, showcasing superior performance compared to state-ofthe-art deep learning and traditional statistical methods. The interpretability offered by the attention mechanism provides valuable insights into the key drivers of climate anomalies, contributing to a better understanding of climate dynamics and aiding in the development of more resilient mitigation and adaptation strategies.
