Reinforcement Learning Approaches for Adaptive Cybersecurity Defense Mechanisms
Abstract
Modern threat environments evolve faster than static, signature-driven controls and manually tuned incident response playbooks. As organizations expand their digital estates and increase dependence on interconnected services, the cybersecurity function must shift from reactive rule enforcement to adaptive decision-making that continuously optimizes defensive actions under uncertainty. Reinforcement learning (RL) offers a principled framework for sequential decisionmaking in dynamic environments, enabling a defender to learn policies that balance risk reduction, service availability, and operational cost. However, autonomous or semi-autonomous cyber defense is constrained by governance, compliance, and strategic alignment requirements at both organizational and national levels. National cybersecurity strategies and policydevelopment attributes emphasize resilience, critical infrastructure protection, accountability, and measurable capability development, all of which impose constraints on automated response. Building on the strategic and governance perspectives in the cybersecurity strategy literature, this paper proposes a policy-aware RL conceptual framework for adaptive cyber defense. The framework integrates telemetry-driven state representation, constrained action selection, and reward shaping tied to strategic objectives and auditability. A deployment-oriented reference architecture is presented, alongside an evaluation methodology that emphasizes safety, policy compliance, and operational effectiveness. The paper contributes an implementable blueprint for aligning RL-based adaptive defense mechanisms with recognized cybersecurity strategy, policy, and assurance considerations.
